Armored Core 2. When the PS2 first came out, it was recommended by a friend and so it was my launch game. I knew nothing about the series at the time. I tried it out and it felt clunky and odd to control, really damn disappointing, but keep in mind, I had only played as the starting AC.
After a day or two, though, I started reconsidering all the possibilities that the garage provides, which if you don't know, you basically can change every part of it, and a wide array of weapon types. So a lightweight, fast, sniper, to a heavy, slow, tank. I began messing with the garage and long story short, I was obsessed with the series, especially the arena, even going so far as to use tunneling software of the time to play against others online, before online gameplay was actually in the games. As the series went on throughout the PS2 era of the series, it only got better in my eyes. I did lose interest in it after trying the PS3 take, though, as it removed some of my favorite features that had been gradually introduced throughout the PS2 era.

Maybe I didn't think they would suck, but these games really were better than expected:

Mark of the Ninja
Judging by the screenshots, I really didn't expect much from the game. Just some platformer, I thought.
But it was on a huge discount the other day (winter 2014) and so I bought it because, being a stealth genre fan, I was really curious about the stealth elements such a game could possibly have.
And well, what do you know - it turned out to be one my most favourite games! I finished it three times, got all achievements and chances are that when I'm bored one day, I will probably play it again :)
Also, based on the reviews that I have read before, I got the impression that Dishonored was a pretty shitty game.
Then it was free on Steam for a weekend so I gave it a try and, much like with Mark of the Ninja, I found out that I actually loved it :)

Max Payne 3. I expected a sunny, horrible and bald betrayal of the series, because that's how it was advertised. Instead, I got a really god damn great Max Payne game

Solar 2. Expected standard bundle filler, found a fun, clever game.

Terraria surprised the hell out of me... I thought it might be a kiddish time killer, but ended up sinking a few hundred hours into it and still going strong. Also a good one to play COOP on the home LAN with my kids.
Also the Borderlands series surprised me a lot too. In watching previews etc, the graphics didn't really sit well with me. One of the biggest mistakes ever. The game is funny as hell and gameplay is brilliant. And once you dial up the GFX, it doesn't look as cartoony. I don't have TPS yet, but BL1/2 are awesome.

To the Moon
The Cat Lady
Borderlands <-- I wasn't too much into RPG's at that time so the fact that I was getting headshots and the enemies weren't dying made me get annoyed. Now I love it though.
EDIT: Spec Ops The Line and Binary Domain should be added too

I bought The Last Remnant recently and honestly, I didn't know what to expect. After the first hour, I thought it was gonna be terrible. After actually playing through a few quests and reading up on it online, as it offered limIted tutorials, I found myself pleasantly surprised by how much this game appeals to me. It lacks as much control as other rpgs, but that just keeps you on your toes. There's an RNG involved which gives the feel of a fire emblem game, where even against the most incredible odds, you can still find a way to pull through and other times, you can end up being destroyed by a few weaker enemies. Your party members largely grow in different areas and act on their own with limited input from the player character, but by forcing situations for units to act in certain ways and by your limited input, you can potentially create an extremely powerful character. And even if you don't know what you're doing, they mostly level up and take care of themselves so you don't even have to do much. The music and environments are simply amazing, and the in battle music changes depending on how well your team is fighting, so that's pretty neat. The battle system is unique, but almost feels like a mix between ffxii, kotor, and tales of Symphonia. Depending on how you organize your team, you can make certain units specialize in different areas without the added input from your pc. The only thing this game is lacking in so far is story and characters unfortunately, but I haven't gotten too far yet, and it definitely has a lot of potential
